MIBench: A Comprehensive AI Benchmark for Model Inversion Attack and Defense

Understanding Model Inversion Attacks Model Inversion (MI) attacks are threats to privacy that target machine learning models. Attackers try to uncover sensitive information, such as private images, health data, financial details, and personal preferences, by reverse-engineering the model's outputs. This poses serious privacy risks, especially for Deep Neural Networks (DNNs). The Challenge As MI attacks become more advanced, there is currently no reliable way to test and compare them. This makes it difficult to assess the security of models. The absence of standardized testing leads to inconsistent results and makes it hard to compare different attack methods. Current Defense Strategies There are two main strategies to defend against MI attacks: 1. **Model Output Processing**: Techniques that limit private information in model outputs. For example, using autoencoders to clean outputs or adding noise to confuse attackers. 2. **Robust Model Training**: Implementing defense measures during the training phase to reduce information leakage. This includes minimizing the mutual information between inputs and outputs. Introducing MIBench To tackle these challenges, researchers developed MIBench, the first benchmark for evaluating MI attacks and defenses. MIBench breaks down the MI process into four parts: - Data Preprocessing - Attack Methods - Defense Strategies - Evaluation MIBench includes 16 methods: 11 for attacks and 4 for defenses, along with 9 evaluation protocols focused on Generative Adversarial Network (GAN)-based attacks. It distinguishes between white-box (full model knowledge) and black-box (limited access) attack methods. Testing and Results Researchers tested MI strategies on two models using various datasets, measuring aspects like accuracy and feature distance. Strong methods like PLGMI showed high accuracy, while others created realistic images, especially at higher resolutions. The effectiveness of MI attacks increased with the model's predictive ability, highlighting the need for better defenses that also maintain model accuracy. Future Implications MIBench will enhance research in the MI field by providing a standardized toolbox for thorough testing and fair evaluations.
